    Exciting New Research: Injecting Domain-Specific Knowledge into Large Language Models I just came across a fascinating comprehensive survey on enhancing Large Language Models (LLMs) with domain-specific knowledge. While LLMs like GPT-4 have shown remarkable general capabilities, they often struggle with specialized domains such as healthcare, chemistry, and legal analysis that require deep expertise. The researchers (Song, Yan, Liu, and colleagues) have systematically categorized knowledge injection methods into four key paradigms: 1. Dynamic Knowledge Injection - This approach retrieves information from external knowledge bases in real-time during inference, combining it with the input for enhanced reasoning. It offers flexibility and easy updates without retraining, though it depends heavily on retrieval quality and can slow inference. 2. Static Knowledge Embedding - This method embeds domain knowledge directly into model parameters through fine-tuning. PMC-LLaMA, for instance, extends LLaMA 7B by pretraining on 4.9 million PubMed Central articles. While offering faster inference without retrieval steps, it requires costly updates when knowledge changes. 3. Modular Knowledge Adapters - These introduce small, trainable modules that plug into the base model while keeping original parameters frozen. This parameter-efficient approach preserves general capabilities while adding domain expertise, striking a balance between flexibility and computational efficiency. 4. Prompt Optimization - Rather than retrieving external knowledge, this technique focuses on crafting prompts that guide LLMs to leverage their internal knowledge more effectively. It requires no training but depends on careful prompt engineering. The survey also highlights impressive domain-specific applications across biomedicine, finance, materials science, and human-centered domains. For example, in biomedicine, domain-specific models like PMC-LLaMA-13B significantly outperform general models like LLaMA2-70B by over 10 points on the MedQA dataset, despite having far fewer parameters. Looking ahead, the researchers identify key challenges including maintaining knowledge consistency when integrating multiple sources and enabling cross-domain knowledge transfer between distinct fields with different terminologies and reasoning patterns. This research provides a valuable roadmap for developing more specialized AI systems that combine the broad capabilities of LLMs with the precision and depth required for expert domains. As we continue to advance AI systems, this balance between generality and specialization will be crucial.

    "If Joe picks this task up, it will take 8 hours, if someone else picks it up, it will take 8 days." What do you think happened? Joe always picked up this kind of work. Doing these tasks reinforced his expertise even further. We ensured that in the future, he would be our best bet to pick up these tasks again. And it ensured everyone in the team was dependent on Joe. And then Joe took some holidays, and the team's productivity dropped. There also was a production issue we really struggled to fix without Joe. He was the bottleneck that prevented the team from moving faster or being able to solve any issues. So, after the holidays, we changed our approach: if there was a task that was perfect for Joe, we did not allow him to pick it up. He had to support whoever was picking it up. We accepted that it would go much slower because we wanted to make the team more resilient for the future. We went slower for many weeks, but after a few months, it paid off. Whenever Joe was on holidays, we could still be productive, and we would also be confident that we could fix any production issues. The team was also more productive than ever before. The moral of the story: sometimes, what seems fast is actually the slow approach. It depends on whether you take the short or long-term perspective. You should always keep in mind that everyone will leave the company at some point. Do you want to be ready before they leave, or do you want to rush to transfer knowledge when it could already be too late?

    Most Train-the-Trainer programmes fail for one simple reason... Transfer is assumed, not designed. A new paper in the International Journal of Training and Development finally tackles a long-standing blind spot in L&D: 👉 How trainers themselves actually learn , and why that learning so often fails to show up in practice. Wisshak et al. (2025) propose a generic “offer-and-use” model for Train-the-Trainer programmes, adapted from teacher education and grounded in decades of transfer research. Training effectiveness is not determined by what is offered, but by how trainers perceive, interpret, and use learning opportunities within their real work context. The model highlights six interacting elements: • Training design & facilitation quality • Individual trainer factors (motivation, self-efficacy, prior knowledge) • Contextual factors (support, culture, opportunity to apply) • Perceived relevance and engagement • Actual learning processes • Outcomes, with transfer (behaviour change) as the non-negotiable criterion What I find particularly important is this: Many trainers are self-employed or freelance, yet most transfer models assume a supportive organisation, manager reinforcement, and stable teams. This paper explicitly addresses that mismatch, suggesting peer networks, follow-ups, feedback loops, and deliberate transfer scaffolding. Implication for L&D: If your Train-the-Trainer programme is evaluated mainly on satisfaction scores or content coverage, you are measuring the least predictive indicators of success. Transfer isn’t a phase. It’s a system property.

Here's what I discovered after working with Fortune 500 companies on their digital transformation initiatives. The problem isn't that AI will eliminate expertise. The problem is how we're thinking about skill transfer. I used to believe that institutional knowledge was either documented or lost. That senior employees either adapted to new technology or became obsolete. It felt binary. Mechanical. Like checking a box. Then I learned something that changed everything. Real skill transfer isn't about replacing human expertise with AI. It's about translating your knowledge into new patterns that work alongside intelligent systems. Here's what actually works: Map your expertise patterns Those decision-making frameworks your senior team uses instinctively. The way they read market signals. Their ability to navigate complex stakeholder dynamics. Create knowledge bridges Don't just document processes. Build connections between traditional methods and AI-enhanced workflows. This trains your systems to recognize expertise. Practice pattern recognition When your experts solve problems, capture the thinking process, not just the solution. "Here's how I knew to pivot the strategy" hits different than forced documentation later. Build translation systems Ask yourself: "How do we make this expertise usable in new contexts?" Your veteran sales director's relationship-building skills become customer success frameworks. Design feedback loops When you apply transferred knowledge, measure what works. "This approach increased client retention by 23%" validates the translation process. The shift happens when you stop trying to preserve expertise and start transforming it into scalable patterns.     Expert decision-makers process patterns 6x faster than they can explain them. That's the real reason your team can't close like you—and why your sales playbook will never fix it. Carnegie Mellon University researchers found that experts aren't thinking through steps. They're matching the current situation against thousands of previous situations—instantly, unconsciously. Cognitive scientists call this tacit knowledge. Michael Polanyi named it in 1958: "We know more than we can tell." The uncomfortable part: the more expert you become, the less able you are to explain what you do. It's called the expertise reversal effect. As skills become automatic, the reasoning behind them becomes invisible—even to you. You don't decide to read the room. You just read it. This is why documentation fails as a transfer method. You can't document a pattern-matching engine. You can only create conditions where someone else builds their own. Three conditions research supports: 1️⃣ Exposure to expert decision-making in real time—not after the fact. 2️⃣ Deliberate practice with feedback in realistic scenarios. 3️⃣ Forced verbalization—the expert narrating their own judgment while it's happening. That third one is the hardest. It requires founders to slow down and articulate what's normally automatic. Uncomfortable. Unnatural. And, it's the single most effective method for transferring tacit expertise.     In the fast-moving world of Generative AI, there is often a tension between proprietary development and open scientific contribution. For my team, the choice is clear: Applied AI thrives on shared knowledge. Our focus remains strong on not just building efficient AI solutions, but on rigorous research and publishing those findings to push the industry forward. We believe that solving the "last mile" challenges—latency, compute costs, and edge deployment—requires an open exchange of ideas. In that spirit, I am proud to share our team’s (Siddharth Tandon) latest publication: "Can abstract concepts from LLM improve SLM performance?" This paper tackles a critical question in Applied AI: How do we make small, efficient models "smarter" without the massive overhead of retraining? Our research proposes a cross-architecture framework that delivers: 🔹 Concept Transfer: A method to extract "abstract concepts" (via steering vectors) from large models (like Llama or Mistral) and transfer them to Small Language Models (SLMs). 🔹 Efficiency First: This technique improves performance without the need for expensive fine-tuning or complex quantization pipelines. 🔹 Measurable Impact: We observed accuracy improvements of 7-15% on smaller models (such as Qwen3-0.6B) by applying these transferred concepts at inference time. This work represents exactly where we want to be: at the intersection of theoretical insight and practical, scalable application.     We often talk about technical debt in software teams, but have you ever considered 𝗸𝗻𝗼𝘄𝗹𝗲𝗱𝗴𝗲 𝗱𝗲𝗯𝘁? 👀 It’s the hidden cost of undocumented or inaccessible know-how in a growing company. In my experience, teams feel this pain daily, even if they don't have a name for it. 𝗪𝗵𝗮𝘁 𝗶𝘀 𝗞𝗻𝗼𝘄𝗹𝗲𝗱𝗴𝗲 𝗗𝗲𝗯𝘁? Knowledge debt is the backlog of important information that hasn’t been documented or shared widely. At first, a little tribal knowledge might seem harmless—everyone just asks Alice for deployment steps or Bob for tricky client questions. But that ends when Alice is on vacation or Bob leaves. Just like technical debt, knowledge debt accumulates "interest." Every time we postpone writing a how-to guide or skip recording the "why" behind a decision, we create knowledge debt by borrowing against future productivity. Rushing a project without docs is like a short term hack in code—it works for now but leaves everyone struggling later. 𝗧𝗵𝗲 𝗜𝗺𝗽𝗮𝗰𝘁 𝗼𝗳 𝗞𝗻𝗼𝘄𝗹𝗲𝗱𝗴𝗲 𝗗𝗲𝗯𝘁 ❌ 𝗪𝗮𝘀𝘁𝗲𝗱 𝘁𝗶𝗺𝗲 𝘀𝗲𝗮𝗿𝗰𝗵𝗶𝗻𝗴: We lose around 1.8 hours a day searching for info—nearly a full day per week even for a small team! ❌ 𝗢𝗻𝗯𝗼𝗮𝗿𝗱𝗶𝗻𝗴 𝗰𝘂𝗿𝘃𝗲: Relying on “ask Joe” for information slows down onboarding, estimated to cost companies millions in lost productivity. ❌ 𝗗𝗲𝗹𝗮𝘆𝗲𝗱 𝗱𝗲𝗰𝗶𝘀𝗶𝗼𝗻𝘀: When information is hard to find, decisions come to a stall. 68% of companies face project delays from missing info. ❌ 𝗥𝗲𝗶𝗻𝘃𝗲𝗻𝘁𝗶𝗻𝗴 𝘁𝗵𝗲 𝘄𝗵𝗲𝗲𝗹: Nearly 59% of R&D and product teams later discover the expertise or project they recreated already existed within their company. ❌ 𝗙𝗿𝘂𝘀𝘁𝗿𝗮𝘁𝗶𝗼𝗻 𝗮𝗻𝗱 𝗰𝗵𝘂𝗿𝗻: 81% of employees feel frustrated when they can’t access the info needed to do their jobs, which can erode morale and push talent to leave. 𝗧𝘂𝗿𝗻𝗶𝗻𝗴 𝗞𝗻𝗼𝘄𝗹𝗲𝗱𝗴𝗲 𝗗𝗲𝗯𝘁 𝗶𝗻𝘁𝗼 𝗞𝗻𝗼𝘄𝗹𝗲𝗱𝗴𝗲 𝗖𝗮𝗽𝗶𝘁𝗮𝗹 ✅ 𝗖𝘂𝗹𝘁𝗶𝘃𝗮𝘁𝗲 𝗮 𝗱𝗼𝗰𝘂𝗺𝗲𝗻𝘁𝗮𝘁𝗶𝗼𝗻 𝗰𝘂𝗹𝘁𝘂𝗿𝗲: Use internal wikis or docs and lead by example—record key decisions and insights. ✅ 𝗕𝗿𝗲𝗮𝗸 𝗱𝗼𝘄𝗻 𝘀𝗶𝗹𝗼𝘀: Host brownbag sessions, circulate newsletters, and rotate team members across projects to share knowledge. ✅ 𝗠𝗲𝗻𝘁𝗼𝗿𝘀𝗵𝗶𝗽: Pair newcomers with veterans to transfer implicit undocumented knowledge. ✅ 𝗧𝗿𝗲𝗮𝘁 𝗸𝗻𝗼𝘄𝗹𝗲𝗱𝗴𝗲 𝗮𝘀 𝗮𝗻 𝗮𝘀𝘀𝗲𝘁: Designate “knowledge champions” or host Documentation Days to regularly “pay down” your debt. This pays off not only with the team, but also with the coming of AI agents who can utilize this knowledge to reliably and accurately get things done. ✅ 𝗠𝗮𝗸𝗲 𝗸𝗻𝗼𝘄𝗹𝗲𝗱𝗴𝗲 𝘀𝗲𝗮𝗿𝗰𝗵𝗮𝗯𝗹𝗲: Invest in tools that unify scattered information. Paying off knowledge debt turns a liability into an asset. When your team's know-how is documented and accessible, you build 𝗞𝗻𝗼𝘄𝗹𝗲𝗱𝗴𝗲 𝗖𝗮𝗽𝗶𝘁𝗮𝗹! New hires get up to speed faster, teams feel unblocked to do their best work, and learnings compound across projects.

    4 employees. 4 solutions. Same problem. A company I worked with "solved" the same efficiency issue 4 times in 2 years. They weren't incompetent. They were busy. And nobody wrote it down. This is innovation's silent killer: knowledge loss. We can run perfect experiments, generate brilliant insights, and still waste months re-learning what we already knew. The fix? Ruthlessly simple documentation. It doesn't matter the area: Marketing, Manufacturing, Engineering, Customer Services, etc. The highest-performing teams I've worked with follow 3 rules: 1️⃣ Every experiment gets a searchable record Not in email. Not in notebooks. In a shared system anyone can access. 2️⃣ Capture insights in under 5 minutes • What we tested • What we learned • What's next • What failed (and why) No 20-page reports. Just the essentials. 3️⃣ Make knowledge transfer intentional One practice we adopted: 15-minute "experiment reviews" every Friday. Each team shares their fastest learning. Within 3 months? Teams were building on each other's breakthroughs. Innovation started compounding. Documentation isn't extra work. It's how we stop paying for the same lesson twice.     Every individual R&D project feels data-starved, despite years of accumulated research. R&D projects often operate with limited data due to time, budget, and staffing constraints. Yet, across an organization, related systems may have been studied extensively over long periods. While intuitively valuable, such collective knowledge is not readily usable in standard ML models, which typically expect consistent protocols and well-aligned datasets. This is where transfer learning can be helpful. It provides a way to selectively reuse relevant structure from prior projects. The goal is not to assume old data is correct everywhere, but to extract what generalizes and actively correct what does not. A recent ChemRxiv preprint illustrates this idea through autonomous phase diagram mapping for materials and biological systems. The authors demonstrate how previously studied, related systems can be leveraged to accelerate new experiments while automatically detecting where that prior knowledge no longer applies. At a high level, the approach: 🔹Uses models trained on previously studied systems as sources of prior knowledge 🔹Learns spatially where each source is reliable in the new system 🔹Actively focuses new experiments on regions where prior knowledge breaks down The result is a ~50% reduction in required measurements compared to standard active learning. Importantly, when prior data turns out to be unhelpful, the method safely falls back to learning from scratch. If we want ML-driven R&D to scale under real-world constraints, models cannot remain amnesic. Transfer learning offers a mechanism for organizations to turn past projects into cumulative insight.
