What are the limitations of AI algorithms and how can you overcome them?

The efficacy of an AI algorithm is heavily contingent on the quality of the data employed. Both the quality and quantity of data play pivotal roles in determining success. Inadequate or substandard data can yield numerous adverse consequences, ranging from biased and misleading outcomes to issues such as overfitting, underfitting, or high variance. It is imperative to guarantee that the collected data meets certain standards. This involves ensuring that the data is clean, free from errors or inconsistencies, consistent in format, complete in scope, and representative of the problem domain at hand. Rigorous attention to data quality is fundamental in fostering the reliability and accuracy of AI algorithms.

Think of it like your favorite music app trying to suggest songs. If it only knows a handful of genres because its database is small (data quantity) and those genres are a bit niche (data quality), you might miss out on discovering new tunes outside those limits. Now, if the app has a vast library covering various genres and artists (good data quality and quantity), it can nail down your preferences and introduce you to a wider musical world, much like a cool friend with an extensive playlist. So, in AI, having a rich and diverse dataset is like expanding the musical horizons of your recommendation system!

From what I have seen, one of the things that more often happens with AI is that not always it is more common to asses whether enough data points are used for the particular hypothesis and how it can be ensured that there is enough quality input that there will be fair chance for results that will bring value in an unbiased way. However with AI, there is tendency for users to overlook the verification examination of the data upon which results are generated and one can easily jump in wrong conclusions.

Absolutely, it’s important to collect useful and meaningful data, as it is the foundation of AI training. During my daily teaching job at Uni, the first thing we need to teach students how to do data pre-processing, data cleaning. In the realm of data pre-processing and cleaning, emphasize the significance of handling missing values, addressing outliers, and standardizing formats. Additionally, guide students through the importance of cross-validation techniques in validating model performance. Illustrate how methods like k-fold cross-validation help assess model generalization by splitting data into multiple subsets for training and testing. Emphasize the role of cross-validation in ensuring model reliability and preventing overfitting.

A bias-variance trade-off is very important. An oversimplified model results in high bias (underfitting); whereas, an overly complex model also learns the noise in the data as data points and results in high variance (overfitting). Both the models have low performance for unseen data. Therefore, an ideal model has both low bias and low variance to accurately capture the underlying trends in the data.

Of course AI algorithms often lack explainability and transparency, it’s a challenge. And up-to certain extent we can overcome those limitations, through various tools- 1) Explainable AI (XAI) tools, such as LIME (Local Interpretable Model-agnostic Explanations) and SHAP (SHapley Additive exPlanations), provide insights into model predictions. 2)Visualization tools like TensorBoard help interpret complex neural network architectures. Additionally, frameworks like Fairness Indicators address transparency concerns by evaluating and visualizing bias in models. However, embracing these tools can enhances the explainability and experience, where fostering transparency is a continuous process to improve trust and quality.

AI is a giant black box with so many layers/steps before arriving at a decision. To address AI interpretability challenges, adopting a hybrid approach combining technical and human-centered methods is effective. This involves using techniques like feature visualization, where the AI system highlights which data points most influenced its decision. It's coupled with expert reviews where AI specialists periodically analyze and summarize AI decisions and their rationales. This dual approach ensures that while the AI's reasoning is technically dissected, it's also contextualized and presented in a manner digestible to the general audience. Such a strategy helps bridge the gap between complex AI operations and human understanding.

Enhancing the explainability and transparency of AI algorithms doesn't always improve trustworthiness... It can make it easier for bad actors to misuse and exploit the system. Also, explainability doesn't guarantee fairness or ethics as clear reasoning can still produce biased or unethical decisions. While transparency is important it should be balanced with security measures and ethical guidelines to prevent unintended consequences. #ai #artificialintelligence

The complications of non-transparent AI problems also include prejudices and ethical concerns. That's why, in May 2019, the European Union published a standard guideline defining the ethical use of AI, which experts are hailing as a major step towards solving AI's black box problem. One step towards dismantling some of the lack of transparency is to analyze the content input and the algorithm's output to better understand the decision-making process. Clarifying black box AI means creating a methodology explainable to the human scale, using simple and understandable data science, that includes a description of the program's decision-making process, including the factors that were weighted and their importance.

Understanding how AI makes decisions is really important. This is about explainability and transparency. It's hard to know why it does what it does, like a locked treasure chest. Tools for Clarity: Using special tools can make AI's decisions clearer. It's like having a guide to understand a really hard book.

Two obstacles need to be overcome for the AI industry to continue expanding: 1) The growing demand for computing power 2) The high costs of training AI models on a large scale Projects focused on decentralizing computer networks can help Artificial Intelligence overcome these challenges. Decentralized Computing Networks (DCN) connect entities seeking computing resources to systems with idle computing capacity, encouraging the contribution of processing resources to the network. These DCNs can offer lower prices compared to traditional centralized providers, which helps to circumvent the obstacle of high costs for training models on a large scale, and also to democratize the development of AI.

One really good way to enhance AI robustness and security is to intentionally introduce weaknesses or vulnerabilities, known as "honeypots" or "decoys". These controlled weaknesses can attract and trap attackers, helping AI systems learn and adapt to new threats. This approach, similar to a biological immune response, enables AI architectures to develop more dynamic defense mechanisms. Yes the data security worries me a lot including but not limited to the data integrity and confidentiality of training data and user input data. Recently, there’s a news that the staff in deep mind find a way to let ChatGPT to spit out its training data that contained personally identifiable information. That totally shows that the data in current AI application is not well protected and the urgency of fixing the bugs related to data security.

AI—and specifically ML—challenge the utility of existing testing tools. In contrast to traditional software, AI addresses problems that are often broader, less clear in purpose, and have more complex input and output spaces. In most cases, existing tools do not scale to these problems; in others, there is no clear analogy, necessitating the creation of new tools. Additionally, AI system tools need to be incorporated into modern software development processes as well as automated development and deployment environments and frameworks. In particular, tools that support robust and secure AI should be integrated into DevOps or MLOps pipelines and systems for Continuous Integration and Continuous Delivery (CI/CD) wherever possible.

It's also important to recognize that the humans, in the loop, or otherwise have multiple inherent biases that they bring to the "party". They sometimes show up sick, tired, with the wrong education or skills, or with hundreds of cognitive biases, which limit their effectiveness as a partner to AI and its algorithms. Algorithmic biases are real, but we must always remember that AI and augmented intelligence doesn't work in a vacuum; it takes two to tango.

If the algorithm unintentionally excludes certain groups or over-represents others, it's like some people getting snubbed while others dominate the dance floor. One crucial aspect to tackle in AI is ensuring accountability in its decision-making processes. AI systems can make decisions impacting lives, such as in healthcare or criminal justice. To ensure these decisions align with societal norms and ethical standards, we must establish clear responsibility chains. This involves not only the developers and operators but also regulatory bodies. Implementing an oversight mechanism, where decisions can be reviewed and appealed, is essential. This approach not only increases trust in AI systems but also ensures that when errors occur, they are rectified swiftly and learnings are integrated into the system.

Synthetic media, or AI-altered or -generated videos or images, are exponentially on the rise. Some estimate that online deepfakes are doubling every six months. Detecting and labeling synthetic media so that people know ahead of time that they are dealing with AI will be key to prevent disinformation. The climate of AI-generated media raises another ethical quandary called the liar’s dividend. This is when people cast doubt on objective evidence as fake or manipulated. This strategy is one of misinformation about misinformation and benefits those who weaponize public skepticism and take advantage of a climate of uncertainty as a means to escape accountability. We can expect to see more of this “deepfake defense.”

From tools that shaped our surroundings to intricate systems that shaped our identities, technology has come a long way. AI now constitutes a quantum leap, establishing a human-machine relationship dynamic. This evolution comes with a crucial trade-off: even if AI can improve human capacities and solve most of our issues, we need to be careful not to lose the ability to think morally. In order to avoid prejudice and uphold human dignity, AI's enormous power must be tempered by moral principles and human oversight. It's critical that, as we embrace AI, our moral judgement is enhanced rather than replaced. This era is about properly integrating AI to improve our lives without sacrificing our fundamental human values.

LLMs struggle with novel tasks (i.e. tasks not in the training data) when we take an outcomes-focused approach. They perform much better when we take a process-focused approach. If we prompt LLMs to reason before giving an answer or we decompose a task into smaller more manageable steps, the performance increases significantly.

Handling the Unknown: One big hiccup for AI is dealing with stuff it hasn't seen before. It's like studying for a surprise test. To tackle this, make your AI more adaptable. You know how you learn on the fly? Well, adaptive learning lets AI do that too, getting better at handling the unexpected, just like you get better at answering questions even if you've never seen them before.

The biggest change from AI generated content is the realisation that the audience has changed. AIs are increasingly not writing for people (in fact the volume of 'content' makes this unmanageable) - they are writing for the other AIs that surface this content to different audiences. This is the fundamental point

AI still has a lot of limitations…we identified a lot of challenges in the AI adiption such us Black Box, Bias, Lack of Data, Lack of skills, and many more. But it’s going to evolve a lot in the next few years and this is great! If we are going to implement regulations, and AI is going to be trustworthy, it’s going to be the best “copilot” that a human can have.

AI models for real world use cases often require high levels of technical expertise and domain specific knowledge also. Some individual developers or small companies this may pose a challenge.
